A decade ago, the battlefield of distributed computing split into two distinct camps.
One was the matrix-centric view: attempts to partition massive matrices into sub-matrices for distributed processing. Within the Hadoop ecosystem, projects like Apache Hama emerged to realize this idea. At the same time, GPUs were steadily growing their memory capacity, maximizing the efficiency of “bulk computation” within a single chip.
The other came from Google. Google proposed a fundamentally different model — treating the web’s link graph as one giant Graph, where each Vertex asynchronously exchanges signals and updates its state. This was Google Pregel. Google later expanded the concept into a CPU-cluster-based system called DistBelief, which eventually faded into obscurity.
Why did this revolutionary “neuron-centric” philosophy lose?
1. Three Walls That Broke Distributed Deep Learning
Implementing deep learning on CPU-based distributed environments was a battle against physical constraints.
The Asymmetry of Compute Density
Algorithms like PageRank are topologically complex but individually lightweight per node. Deep learning, by contrast, requires multiplying tens of thousands of parameters in a matrix just to update a single neuron. General-purpose CPUs simply could not bear this computational weight.
The Data Movement Curse (Memory Wall)
Passing a neuron’s state to a neighboring node meant traversing L3 cache → RAM → NIC → Switch. Moving data took 100× longer than computing it — a classic case of the tail wagging the dog.
The Limits of BSP (Barrier Synchronization)
Bulk Synchronous Parallel (BSP) requires every node to wait until all others finish before proceeding. In a cluster of thousands of servers, a single straggler forces the entire system to slow down to its pace — a fatal bottleneck.
2. Hardware Catches Up: The NPU
The fundamental challenges of distributed computing never disappeared — but the hardware landscape has finally changed. NPUs (Neural Processing Units) have emerged as the physical substrate that can make this old philosophy real.

On-chip SRAM as a neuron cache: NPUs pack tens of megabytes of dedicated SRAM directly on-chip. Neuron states no longer need to make the expensive round trip to off-chip RAM. The Memory Wall begins to dissolve at the hardware level.

Embedded Matrix Engine: Even when computation is decomposed to individual neuron granularity, the local arithmetic within each shard is handled at full speed by the NPU’s built-in Matrix Engine. The compute density problem is solved via a graph-and-matrix hybrid.

Deterministic Scheduling: NPUs can predict computation completion time at nanosecond granularity. This enables asynchronous pipelining without the blunt-force barrier synchronization of the past.
3. The Paradigm Shift: Then vs. Now
Today, GPUs’ “massive matrix compression” approach is hitting the wall — both in memory bandwidth and power efficiency. This is precisely why the distributed graph (Vertex-centric) model deserves a second look.

4. vLLM-RBLN: Where vLLM Meets DistBelief
vLLM’s PagedAttention optimizes memory management within a single chip — a Matrix-centric advancement. But when you scale to hundreds of NPUs in a cluster, communication overhead resurfaces as a hard wall. Rebellions’ strategy of capturing the market through vllm-rbln is clever, but viewed through the lens of DistBelief, a new set of challenges comes into focus.

vLLM (the efficient manager): PagedAttention eliminates KV cache memory fragmentation. This is an extension of single-chip resource management optimization — Matrix-centric at its core.

The collision and the opportunity:
vllm-rblnhas captured per-chip performance, but scaling to hundreds of NPUs reintroduces the communication overhead wall. The next step requires extending vLLM’s memory page management into a cluster-wide distributed shared memory — the resurrection of Vertex-centric thinking.
State of Play: Existing Solutions (GPU-Cluster Scope)
Multiple layers of the stack are already being addressed:

Distributed KV cache storage: Mooncake (Baidu), InfiniStore (ByteDance), and LMCache all provide distributed object storage or caching. LMCache is specifically designed to offload KV caches from GPU memory and transfer them for reuse across distributed inference engines.

Cluster-wide memory fabric: Crusoe’s MemoryAlloy treats KV as a first-class memory object across the entire cluster — a unified memory plane decoupled from any single model or runtime. As the cluster scales, each node contributes its GPU KV capacity to a shared pool, and cache hit probability scales linearly with cluster size.

Kubernetes-based orchestration:
llm-d, an open-source project from IBM, Google, and Red Hat, uses vLLM as its base engine and connects external distributed stores like LMCache and Mooncake via a KV connector abstraction, with InfiniBand/RoCE RDMA for inter-node KV cache transfer.
But the unsolved challenges are real. Many optimization techniques — speculative decoding, VLMs — remain incompatible with distributed environments. Inter-node GPU networking libraries like NIXL are still in early stages. Fault tolerance, straggler handling, and hardware failure recovery at scale remain open problems.
Most critically: every one of these solutions is GPU-cluster-only. There is no publicly known implementation of an equivalent distributed KV cache layer on NPU hardware like Rebellions’ RBLN. Reproducing the GPU ecosystem’s RDMA and NCCL semantics on an NPU-native fabric — that is the puzzle vllm-rbln must solve next.
5. Conclusion: The Distributed Computing Revival
A decade ago, the hardware was not ready to support the philosophy — and what seemed like a visionary idea ended up as a historical footnote. Today, the hardware is ready and waiting for the philosophy to catch up.
The unfinished work of efficient distributed deep learning — and complex scientific computation alongside it — is now positioned to be reborn on NPU clusters as a modern DistBelief.
The old idea did not die. It was simply waiting for the right machine.
